Spectral Ghost in (Self-supervised) Representation Learning
Bo Dai Georgia Tech
Motivation
Self-supervised learning is everywhere

A single recipe — pretext task on unlabeled data, then transfer — now powers almost every modality:

Text

Next-token prediction (GPT), masked LM (BERT), contrastive text embeddings (word2vec).

Vision

SimCLR, MoCo, BYOL, SimSiam, Barlow Twins, VICReg, DINO, MAE …

Multi-modal

CLIP, SigLIP, SogLIP / AmorLIP / NeuCLIP, audio-visual, video-text.

Decision & science

Linear-MDP rep for RL & control, causal IV / proxy, animal behavior.

The empirical payoff is huge — but the theory is scattered across paradigms.

Motivation
A dizzying variety of SSL objectives

How do you characterize a method?

  • Contrastive vs. non-contrastive
  • Stationary vs. non-stationary negatives
  • Siamese vs. asymmetric projector vs. momentum
  • Instance vs. clustering vs. masked vs. denoising

Every axis spawns a new family with its own loss, its own trick, its own taxonomy…

…and every family claims its own principle

Motivation
Two questions the field has never answered cleanly

Q1   What is a sufficient representation?

A representation is sufficient & effective if downstream tasks can be solved by light-weight functions on top of it, not on the raw input.

Q2   How to learn it efficiently?

Objective should admit an unbiased stochastic estimator, scale to massive unlabeled data, need no labels.
Claim of this talk:   one spectral view of the transition operator answers both questions and unifies the zoo.
Roadmap
One-slide preview of the story
  1. Sufficiency — spectral factorization of the PMI \(\frac{\mathbb{P}(x',x)}{\mathbb{P}(x')\mathbb{P}(x)}\) gives a universal sufficient representation.
  2. Unified framework — every SSL method learns it; they differ only in parametrization × optimization.
  3. New algorithms — better stochastic estimators, by design.
  4. Applications — regression, causal inference, RL.
Take-away One target — the spectral rep of pairwise mutual information. Only the recipe changes.
1
Sufficiency of the Spectral Representation
What makes a representation enough for any downstream task — and can we extract it from unlabeled data alone?
Sufficiency
Start from the prediction task: SVD of P(y|x)

For any downstream target \(y\), SVD-factorize the conditional:

\[ \mathbb{P}(y\mid x) \;=\; \bigl\langle \phi(x),\; \mu(y) \bigr\rangle \]

The optimal least-squares predictor is then linear in \(\phi(x)\):

\[ \mathbb{E}[y\mid x] \;=\; \bigl\langle \phi(x),\; \underbrace{\textstyle\int y\,\mu(y)\,dy}_{w} \bigr\rangle \]
But… \(\phi(x)\) is task-dependent — a different task induces a different SVD subspace. We need one representation sufficient for any task.
φ₁ φ₂ φ₃ task A task B
each task → a different subspace
Sufficiency
Route the answer through the transition operator P(x'|x)

Let \(\psi(x)\) span the union of all SVD subspaces of \(\mathbb{P}(y\mid x)\) over every task (the core set, with \(\mathbb{P}(z\mid x) = \langle \nu(z),\, \psi(x)\rangle\)). Then for any neighbor \(x'\):

\[ \mathbb{P}(x'\mid x) \;=\; \int \mathbb{P}(x'\mid z)\,\mathbb{P}(z\mid x)\,dz \;=\; \mathbb{P}(x')\,\Bigl\langle \psi(x'),\; \underbrace{\Bigl(\textstyle\int\!\tfrac{\nu(z)\nu(z)^\top}{\mathbb{P}(z)}\,dz\Bigr)}_{A}\,\psi(x) \Bigr\rangle \]

Since \(A = B^\top B\) is full-rank, define \(\varphi(x) := B\,\psi(x)\). Then

\[ \boxed{\;\frac{\mathbb{P}(x,x')}{\mathbb{P}(x)\mathbb{P}(x')} \;=\; \bigl\langle \varphi(x'),\; \varphi(x) \bigr\rangle\;} \]
the spectral / pointwise-mutual-information factorization

\(\varphi\) and \(\psi\) span the same space ⇒ \(\mathbb{E}[y|x] = \langle \varphi(x), w\rangle\) for every task.

Sufficiency · Main Result
Universal sufficient representation from unlabeled data
The spectral factor \(\varphi(x)\) of the PMI \(\dfrac{\mathbb{P}(x,x')}{\mathbb{P}(x)\mathbb{P}(x')}\)   is
(i) sufficient for linearly representing \(\mathbb{E}[y|x]\) for any \(y\), and
(ii) extractable from unlabeled \((x,x')\) pairs only.
The target of representation learning is the spectral decomposition of the PMI operator.  Everything else is parametrization + optimization.

The target of representation learning is the spectral decomposition of the PMI operator.  Everything else is parametrization + optimization.
Unified Framework
The algorithmic recipe, in three steps

1. Parametrize the PMI

Choose a form for \(\tfrac{\mathbb{P}(x,x')}{\mathbb{P}(x)\mathbb{P}(x')}\): linear / EBM / latent-var / nonlinear kernel.

2. Choose an objective

Square match, NCE, density-ratio (f-divergence), or variational power iteration.

3. Optimize

Stochastic gradient when the objective admits unbiased sampling; beware biased gradients in covariance-regularized losses.

This recipe will now walk through the four parametrizations in turn.

Direct Spectral
The normalized transition operator T(x,x′)

Recall the spectral parametrization of the PMI as an inner product of spectral factors:

\[ \frac{\mathbb{P}(x',x)}{\mathbb{P}(x)\mathbb{P}(x')} \;=\; \bigl\langle \varphi(x'),\varphi(x)\bigr\rangle \]

Rescale by the marginal densities to get a tractable target:

\[ T(x,x') \;:=\; \frac{\mathbb{P}(x',x)}{\sqrt{\mathbb{P}(x)\mathbb{P}(x')}} \;=\; \sqrt{\mathbb{P}(x)\mathbb{P}(x')}\,\bigl\langle \varphi(x'),\varphi(x)\bigr\rangle \]

Spectral learning = find \(\varphi\) such that \(\langle\varphi(x'),\varphi(x)\rangle\) matches \(T\) on observed pairs.

Direct Spectral · Method
Spectral Contrastive Loss (HaoChen et al., 2021)

Mean-square match of \(T\) against the rank-\(d\) reconstruction \(\sqrt{\mathbb{P}(x)\mathbb{P}(x')}\langle\varphi(x'),\varphi(x)\rangle\):

\[ \begin{aligned} \min_\varphi\, \ell(\varphi) \;&:=\; \int \bigl\| T(x,x') - \sqrt{\mathbb{P}(x)\mathbb{P}(x')}\,\bigl\langle \varphi(x'),\varphi(x)\bigr\rangle \bigr\|^2 \, dx\,dx' \\[2pt] &=\; \underbrace{\int T(x,x')^2\,dx\,dx'}_{\text{constant}} \;-\; 2\,\mathbb{E}_{\mathbb{P}(x,x')}\!\bigl[\varphi(x)^\top\varphi(x')\bigr] \;+\; \mathbb{E}_{\mathbb{P}(x)\mathbb{P}(x')}\!\bigl[(\varphi(x)^\top\varphi(x'))^2\bigr] \end{aligned} \]
  • First term: alignment on positive pairs (from \(\mathbb{P}(x,x')\)).
  • Second term: uniformity on negative pairs (independent \(\mathbb{P}(x)\mathbb{P}(x')\)).
  • Both expectations admit unbiased minibatch estimators ⇒ SGD-friendly.
Direct Spectral · Method
Barlow Twins is spectral with orthonormalized embedding

Introduce a full-rank linear projection \(\xi(x) = Z^\top\varphi(x)\) with \(Z = U\Lambda^{-1}\) and \(A = \mathbb{E}[\varphi(x)\varphi(x)^\top] = U\Lambda U^\top\). The SVD condition becomes

\[ \begin{aligned} \mathbb{E}_{\mathbb{P}(x', x)}[\xi(x)\xi(x')^\top] &= \int T(x,x')\,\sqrt{\mathbb{P}(x)}\,\xi(x)\,\sqrt{\mathbb{P}(x')}\,\xi(x')^\top \, dx\,dx' \\[2pt] &\quad=\; \Bigl\langle \textstyle\int \mathbb{P}(x)\,\xi(x)\,\varphi(x)^\top dx,\;\; \int \varphi(x')\,\mathbb{P}(x')\,\xi(x')^\top dx' \Bigr\rangle \;=\; Z^\top A^\top A Z \;=\; \mathbf{I} \end{aligned} \]

Minimizing squared error from \(\mathbf{I}\) with a regularization coefficient \(\lambda\) recovers the exact Barlow-Twins objective:

\[ \min_{U,\varphi}\;\sum_{i=1}^d (1-C_{ii})^2 \;+\; \lambda \sum_{i\ne j} C_{ij}^2,\qquad C = \mathrm{Cov}\bigl[\xi(x),\xi(x')\bigr] \]
Direct Spectral · Method
VICReg is spectral with a penalty-method objective

Linear projection \(Z=U\Lambda^{-1/2}\) — orthonormality (Eq. 15) & variational SVD characteristic (Eq. 16):

\[ \begin{aligned} &\mathbb{E}[\xi(x)\xi(x)^\top] = Z^\top\,\mathbb{E}[\varphi(x)\varphi(x)^\top]\,Z = \mathbf{I} \\[3pt] &\max_\xi \int T(x,x')\sqrt{\mathbb{P}(x)}\,\xi(x)^\top\sqrt{\mathbb{P}(x')}\,\xi(x')\,dx\,dx' = \mathbb{E}_{\mathbb{P}(x,x')}\!\bigl[\xi(x)^\top\xi(x')\bigr] \end{aligned} \]

Combine via the penalty method:

\[ \min_\xi\; -\mathbb{E}_{\mathbb{P}(x,x')}\!\bigl[\xi(x)^\top\xi(x')\bigr] \;+\; \eta\underbrace{\Bigl(\textstyle\sum_{i\ne j}\mathrm{Cov}^2(\xi(x)) + \mathrm{Cov}^2(\xi(x'))\Bigr)}_{\text{covariance term}}\;+\; \lambda\underbrace{\sum_{i=1}^d \max\!\bigl(0,1-\sqrt{\mathrm{diag}\,\mathrm{Cov}[\xi(x)]}\bigr)}_{\text{variance term}} \]
Direct Spectral · Method
BYOL & MINC are power iteration for the PMI operator

Fixed-point condition of the spectral rep \(\xi = Z^\top\varphi\):

\[ \int T(x,x')\sqrt{\mathbb{P}(x')}\,\xi(x')\,dx' \;=\; \Lambda\sqrt{\mathbb{P}(x)}\,\xi(x) \]

Iterate three conceptual steps:

  1. \(\Lambda_{t+1} \leftarrow \mathbb{E}[\xi_t(x)\xi_t(x)^\top]\)  — EMA of covariance.
  2. match \(\xi_{t+1}(x) \approx \Lambda^{-1}\!\int T\,\xi_t(x')\,dx'\)  — predictor head on the online branch.
  3. orthogonalize  — self-normalization or Gram-Schmidt.
What the tricks really are Target encoder + momentum = previous-iterate \(\xi_t\).   Predictor head = \(\Lambda^{-1}\) in the power update.   No collapse because each step preserves the top-\(d\) eigenspace.

Non-contrastive ≠ free lunch: the hidden bias

Folklore: contrastive needs large batches because of negatives. Actual culprit: bias in the stochastic gradient.

Compatible with SGD (unbiased)

  • Spectral Contrastive
  • BYOL · MINC (square loss)
  • binary / rank NCE

Biased — needs big batches

  • Barlow Twins: \((1-C_{ii})^2\) is nonlinear in expectation
  • VICReg: covariance-squared penalty

Implication: the contrastive-vs-non-contrastive debate is miscast — the real axis is bias vs unbiased gradient.

Replace the linear factorization with an energy-based one:

\[ \mathbb{P}(x'\mid x) \;=\; \mathbb{P}(x')\,\exp\!\bigl(v(x')^\top v(x)\bigr) \]

\(v(x)\in\mathbb{R}^d\) is low-dimensional, yet the spectral factor \(\varphi\) implied by this parametrization will be infinite-dimensional.

Random Fourier features → infinite-dim spectral rep

Expand the quadratic exponent \(\exp(v(x')^\top v(x)) = e^{\|v(x')\|^2/2}\,e^{-\|v(x')-v(x)\|^2/2}\,e^{\|v(x)\|^2/2}\). The middle factor is a Gaussian kernel; Bochner gives

\[ e^{-\|v(x')-v(x)\|^2/2} \;=\; \bigl\langle \varphi_\omega(x'),\,\varphi_\omega(x)\bigr\rangle_{\mathcal{N}(\omega)}, \qquad \varphi_\omega(x) := e^{-i\omega^\top v(x)}\,e^{\|v(x)\|^2/2} \]
Bridge A finite-\(d\) energy network \(v\) implicitly defines an infinite-dimensional linear spectral rep \(\varphi_\omega\) — the "spectral ghost".

Generalizes to any positive-definite kernel on \(v(x),v(x')\) — used later for nonlinear projector view.

Energy-Based · Method
SimCLR = rank-NCE on the energy-based spectral rep

Plug EBM into the \(k\)-way posterior \(p_\theta(k|\{x'_i\},x) = \dfrac{e^{v(x'_k)^\top v(x)}}{\sum_j e^{v(x'_j)^\top v(x)}}\). Minimizing the multi-class log-loss:

\[ \min_v \; -\mathbb{E}_{\mathbb{P}(x,x')}\!\bigl[v(x')^\top v(x)\bigr] \;+\; \mathbb{E}_{\mathbb{P}(x)}\!\left[\log\!\sum_{i} e^{v(x'_i)^\top v(x)}\right] \]

Restricting \(\|v(x)\|_2=1\) (L2-normalize) gives the exact SimCLR loss.

Latent-Variable Spectral Representation
DeepCluster · SeLa · DINO · SwAV — P(z|x) itself is a spectral rep.
Latent-Variable
P(z|x) is itself a sufficient spectral representation

The latent marginal \(\mathbb{P}(z|x)\) gives a spectral decomposition of the transition operator:

\[ \begin{aligned} \mathbb{P}(x'\mid x) &= \int \mathbb{P}(x'\mid z)\,\mathbb{P}(z\mid x)\,dz \;=\; \int \frac{\mathbb{P}(z\mid x')\,\mathbb{P}(x')}{\mathbb{P}(z)}\,\mathbb{P}(z\mid x)\,dz \\[3pt] &= \mathbb{P}(x')\,\Bigl\langle \sqrt{\Lambda(z)}\,\mathbb{P}(z\mid x'),\;\; \sqrt{\Lambda(z)}\,\mathbb{P}(z\mid x)\Bigr\rangle_{L_2} \end{aligned} \]

where \(\Lambda(z)=\tfrac{1}{\mathbb{P}(z)}\) is a diagonal operator, so \(\sqrt{\Lambda(z)}\,\mathbb{P}(z|x)\) spans the same function space as \(\mathbb{P}(z|x)\).

Consequence \(\mathbb{P}(z|x)\) is a constrained linear spectral rep (simplex-valued); learning the latent model learns the rep.

Trade-off: simplex constraint can cost dimensions (Prop 2 of Agarwal et al. 2020) but enables probabilistic modeling.

Multi-Modal
CLIP is log-sum-exp biased — the SogLIP / AmorLIP / NeuCLIP story

MLE of the multi-modal EBM requires computing \(Z(x), Z(y)\). Three ways to sidestep:

SogLIP

Nonparametric moving-average of \(Z_x^t, Z_y^t\) — \(O(n)\) memory, cheap updates.

AmorLIP

Amortize \(Z(x),Z(y)\) in a tiny network on top of \(\phi,\nu\) — fits our Eq. 53.

NeuCLIP

Fenchel dual of the partition function — convex surrogate, unbiased.
Same axis everywhere Whether language-image or single-modal SSL, the method's reach is dictated by how you estimate the partition function — bias vs memory vs tuning.

Applications · Regression & Classification
Light-weight downstream: a linear head is enough

With sufficient spectral rep \(\varphi(x)\), so that \(\mathbb{P}(y\mid x) = \langle \varphi(x), \mu(y) \rangle\), the optimal regressor and Bayes classifier both reduce to linear maps:

Regression

\[ \begin{aligned} \mathbb{E}[y\mid x] &= \int y\,\mathbb{P}(y\mid x)\,dy \\ &= \bigl\langle \varphi(x),\, \underbrace{\textstyle\int y\,\mu(y)\,dy}_{w}\bigr\rangle \end{aligned} \]
Any L1/L2/robust statistic inherits the same structure.

Classification

\[ \begin{aligned} R(y{=}i\mid x) &= \textstyle\sum_{j} \omega(i,j)\,\mathbb{P}(y{=}j\mid x) \\ &= \textstyle\sum_{j} \omega(i,j)\,\bigl\langle \varphi(x),\mu(y{=}j)\bigr\rangle \\ &= \bigl\langle \varphi(x),\, \underbrace{\textstyle\sum_{j} \omega(\cdot,j)\,\mu(y{=}j)}_{W=\Omega\mu(\cdot)}\bigr\rangle \\ &\Rightarrow\ \arg\min_{y}\,\langle W_y,\varphi(x)\rangle \end{aligned} \]
Bayes decision, logistic, softmax — all linear heads.

This justifies why linear probes are the accepted SSL evaluation protocol — they are the optimal downstream.

Applications · Control & RL
Spectral MDP: a universal feature for value functions

Spectral factorization of the transition \(\mathbb{P}(s'|s,a) = \langle\varphi(s,a),\mu(s')\rangle\)  +  \(r(s,a)=\langle\varphi(s,a),\theta_r\rangle\) implies, for any policy \(\pi\):

\[ Q^\pi(s,a) \;=\; \bigl\langle \varphi(s,a),\,\underbrace{\theta_r + \gamma\!\int \mu(s')V^\pi(s')\,ds'}_{\eta^\pi}\bigr\rangle \]
  • Linear LSTD ⇒ efficient TD learning.
  • Posterior over \(\eta^\pi\) ⇒ tractable exploration bonuses.
  • Works for low-rank, partial-observable, and continuous-control MDPs (Ren · Zhang · Shribak · Gao · Nabati et al.).

Same spectral rep that underlies SSL vision models can be learned for dynamics ⇒ one encoder for perception, control, and planning.

Applications · Causal Inference
Instrumental variables & proxy causal inference

IV regression: instrument \(z\), treatment \(x\), outcome \(y\), confounder \(\epsilon\); structural map \(f:x\to y\). With \(\mathbb{P}(z|x)=\mathbb{P}(z)\langle\varphi(x),\mu(z)\rangle\), \(\mathcal{E}f\) is spectral in \(\mu(z)\):

\[ \mathcal{E}f = \int f(x)\,\mathbb{P}(x|z)\,dx = \Bigl\langle \mu(z),\, \underbrace{\textstyle\int f(x)\,\varphi(x)\,\mathbb{P}(x)\,dx}_{w_f}\Bigr\rangle \]

Split \(f = f^\parallel + f^\perp\) (\(f^\perp\in\mathcal{N}(\varphi)\)); the \(\perp\)-part vanishes:

\[ \mathbb{E}_{x|z}[f] = \bigl\langle \mu(z),\,\textstyle\int \varphi(x) f^\parallel(x)\mathbb{P}(x)dx\bigr\rangle + \underbrace{\bigl\langle \mu(z),\,\textstyle\int \varphi(x) f^\perp(x)\mathbb{P}(x)dx\bigr\rangle}_{=\,0} \]
Both sides are spectral Effective \(f(x)=v^\top\varphi(x)\), no loss; primal \(\varphi(x)\) & dual \(\mu(z)\) share the SVD of \(\mathbb{P}(x|z)\).

Barlow Twins — full derivation

Denote \(A := \mathbb{E}[\varphi(x)\varphi(x)^\top] = U\Lambda U^\top\). Choose \(Z=U\Lambda^{-1}\), \(\xi(x)=Z^\top\varphi(x)\). SVD variational form:

\[ \int T(x,x')\sqrt{\mathbb{P}(x)}\xi(x)\sqrt{\mathbb{P}(x')}\xi(x')^\top dx\,dx' \;=\; Z^\top A^\top A Z \;=\; \mathbf{I} \]

Therefore \(\min_\xi \|\mathbf{I} - \mathbb{E}_{\mathbb{P}(x,x')}[\xi(x)\xi(x')^\top]\|_F^2\). Let

\[ C_{ij} = \Lambda^{-1}U^\top\mathbb{E}_{\mathbb{P}(x,x')}[\varphi(x)\varphi(x')^\top]U\Lambda^{-1}, \qquad U^\top \mathbb{E}[\varphi\varphi^\top]U = \Lambda. \]
\[ \Rightarrow\;\min_{U,\varphi}\; \sum_i (1-C_{ii})^2 + \lambda\sum_{i\ne j} C_{ij}^2 \quad\text{(exact Zbontar et al. '21)} \]

Bias. \((1-C_{ii})^2\) is a square-of-expectation ⇒ stochastic gradient is biased; requires large batches.

Appendix A2
BYOL — full fixed-point derivation

Set \(Z=U\); fixed-point eigenvalue condition:

\[ \int T(x,x')\sqrt{\mathbb{P}(x')}\,\xi(x')\,dx' \;=\; \Lambda\sqrt{\mathbb{P}(x)}\,\xi(x) \]

Iterate:  learn \(\Lambda\) with \(\xi_t\) fixed:

\[ \min_\Lambda \; \mathbb{E}_{\mathbb{P}(x',x)}\!\bigl[\|\Lambda\xi_t(x) - \xi_t(x')\|_2^2\bigr] \]

then learn \(\xi_{t+1}\) with \(\Lambda\) fixed:

\[ \min_\xi \; \mathbb{E}_{\mathbb{P}(x',x)}\!\bigl[\|\Lambda\xi(x) - \xi_t(x')\|_2^2\bigr] \]

Together = exact BYOL (Grill et al. 2020). \(\Lambda\) = predictor head; \(\xi_t\) = target network.

MINC variant uses a generalized Hebbian rule with lower-triangular matrix operation for orthogonalization (Guo et al. 2025).

Appendix A3
SimCLR = rank-NCE on the EBM parametrization

EBM \(\mathbb{P}(x'|x) \propto \mathbb{P}(x')\exp(v(x')^\top v(x))\). Plug into rank posterior:

\[ p_\theta\!\bigl(k\,|\,\{x'_i\}_{i=1}^k, x\bigr) \;=\; \frac{\exp(v(x'_k)^\top v(x))}{\sum_{j=1}^k \exp(v(x'_j)^\top v(x))} \]

Multi-class logistic regression:

\[ \min_v -\mathbb{E}_{\mathbb{P}(x,x')}\!\bigl[v(x')^\top v(x)\bigr] + \mathbb{E}_{\mathbb{P}(x)}\!\left[\log\!\sum_i \exp(v(x'_i)^\top v(x))\right] \]

With L2-normalization \(v \to v/\|v\|_2\): exact SimCLR.

Partition-function handling. EBM with normalizer \(Z(x) = \int\mathbb{P}(x')e^{v(x')^\top v(x)}dx'\) can be absorbed into \(\phi_\omega(x)\) via Fourier decomposition (Eq. 53 of the paper).

Appendix A4
DINO & SwAV — full derivation

Latent spectral property: \(\int\mathbb{P}(z|x')\mathbb{P}(x'|x)dx' = \mathbb{P}(z|x)\). KL-match at iteration \(t\):

\[ \min_{\mathbb{P}(z|x)}\;\mathbb{E}_{x,x'}\mathbb{E}_{\mathbb{P}_t(z|x')}[\log\mathbb{P}(z|x)] \;+\; \mathbb{E}_{x,x'}\mathbb{E}_{\mathbb{P}_t(z|x)}[\log\mathbb{P}(z|x')] \]

Softmax \(\mathbb{P}(z|x) \propto \exp(v(x)^\top W_z + b_z)\) gives

\[ \max_v \;\hat{\mathbb{E}}_{x,x'}\mathbb{E}_{\mathbb{P}_t(z|x)}\!\Bigl[v(x)^\top W_z + b_z - \log\!\sum_z e^{v(x)^\top W_z + b_z}\Bigr] + \text{(swap roles)} \]
  • DINO: \(\mathbb{P}_t(z|x)\) = previous iteration teacher ⇒ EMA + centering + sharpening.
  • SwAV: \(\mathbb{P}_t(z|x)\) via optimal-transport Sinkhorn (same as SeLa E-step).
Appendix A5
Diffusion spectral representation — full derivation

Gaussian-noised sample \(\tilde x'\sim\mathcal{N}(\sqrt{1-\beta}x',\beta\sigma^2 I)\):

\[ \mathbb{P}(\tilde x'|x;\beta) \;=\; \int \mathbb{P}(\tilde x'|x';\beta)\mathbb{P}(x')\exp(v(x)^\top v(x'))dx' \;\propto\; \exp(v(x)^\top\mu(\tilde x',\beta)) \]

Tweedie's identity: \(\nabla_{\tilde x'}\log\mathbb{P}(\tilde x'|x;\beta) = \mathbb{E}_{\mathbb{P}(x'|\tilde x',x;\beta)}[\nabla_{\tilde x'}\log\mathbb{P}(\tilde x'|x';\beta)]\), Gaussian case:

\[ \tilde x' + \beta\sigma^2 v(x)^\top \zeta(\tilde x',\beta) \;=\; \sqrt{1-\beta}\,\mathbb{E}[\,x'\,] \]

Learn \(v, \zeta\) by the denoising objective (above). Same network provides the generative model and the spectral representation.

Appendix A6
Restricted Boltzmann machine & contrastive divergence

Softmax \(\mathbb{P}(z|x)\) with Gaussian emission \(\mathbb{P}(v(x)|z) = \mathcal{N}(Cz,\sigma^2 I)\):

\[ \max_{W,v}\;\mathbb{E}_x\!\Bigl[\log\!\sum_z e^{v(x)^\top W z} - \log\!\int\!\sum_z e^{v(x)^\top W z}dx\Bigr] \]

Blockwise-Gibbs sampling of \((x,z)\) via Langevin on \(x\)-side, softmax on \(z\)-side ⇒ Hinton's contrastive divergence on the latent spectral model.

Bonus sampler New alternative: sample \(y\sim\mathcal{N}(Cz,\sigma^2 I)\), then take \(x = \arg\min_x\|y-v(x)\|^2\). Avoids Langevin's step-size tuning.
Appendix A7
Adversarial training for latent spectral rep

Fenchel dual of the intractable f-divergence:

\[ \min_{\mathbb{P}(z|x)}\,\mathbb{E}_{x,x'}\mathbb{E}_{\mathbb{P}(z|x')}\!\left[f\!\left(\tfrac{\mathbb{P}(z|x)}{\int \mathbb{P}(z|x')\mathbb{P}(x'|x)dx'}\right)\right] \]
\[ =\;\min_{\mathbb{P}(z|x)}\max_{g}\; \mathbb{E}_{x\sim\mathcal{D}}\mathbb{E}_{\mathbb{P}(z|x)}[g(x,z)] - \mathbb{E}_{x\sim\mathcal{D}}\mathbb{E}_{\mathbb{P}(z|x')\mathbb{P}(x'|x)}[f^*(g(x,z))] \]

Continuous \(z\): reparameterization.  Discrete \(z\): enumerate.  Min-max saddle — needs stabilization in practice.
